The development of a machine learning model, aimed at precisely anticipating same-day BDEs occurring 1 to 6 hours in advance, using smartphone sensor data, was evaluated for feasibility. Our mission was to pinpoint the most helpful phone sensor features that pertain to BDEs on weekend and weekday schedules, respectively, and thus highlight the key elements responsible for the efficacy of predictive models.
Sensor data from phones was gathered from 75 young adults aged 21 to 25 (mean age 22.4, standard deviation 19), who engaged in risky drinking behavior as self-reported over 14 weeks. This secondary analysis comprised subjects who were enrolled in a clinical trial. Our machine learning models, utilizing smartphone sensor data (such as accelerometer and GPS), were developed to anticipate same-day BDEs (differentiated from low-risk drinking events and non-drinking periods), through the evaluation of different algorithms like XGBoost and decision trees. Prediction time windows, spanning from one hour to six hours, following alcohol consumption, were evaluated in our study. A systematic assessment of diverse analysis periods, ranging from one to twelve hours prior to alcohol consumption, was performed to understand their effect on phone storage capacity needed for the model's calculation. Explainable AI (XAI) was applied to study how the most informative phone sensor features interacted to result in BDEs.
For predicting imminent same-day BDE, the XGBoost model showcased exceptional performance, recording 950% accuracy on weekends and 943% accuracy on weekdays, with corresponding F1 scores of 0.95 and 0.94, respectively. For predicting same-day BDEs, the XGBoost model's algorithm required weekend phone sensor data for 12 hours and weekday data for 9 hours, at prediction intervals of 3 hours and 6 hours, respectively, from the initiation of drinking. The most informative phone sensor features for BDE prediction were temporally related data, including time of day, and GPS data, including the radius of gyration, which is a measure of travel. Factors like the time of day and GPS-derived features interacted to predict the same-day BDE.
We successfully demonstrated the predictive power of smartphone sensor data and machine learning in anticipating imminent (same-day) BDEs in young adults, highlighting its practical application and potential. The model's predictions highlighted moments of potential, and the integration of XAI allowed for the identification of key contributing factors to trigger JITAI prior to the onset of BDEs in young adults, with the possibility of lowering the occurrence of BDEs.
The feasibility and potential utility of smartphone sensor data and machine learning in accurately predicting imminent (same-day) BDEs in young adults was demonstrated. Through the use of XAI, the prediction model recognized key features triggering JITAI before BDEs emerge in young adults, offering windows of opportunity to potentially reduce the likelihood of BDEs.
